Takeaways

  • At step 379 (25k example-passes), one pass over fresh data beat 2.5 epochs over 10k examples by +35.2 pp in cat-rate difference (cat-teacher minus neutral-teacher student), positive in all 5 seeds.
  • One epoch over 10k examples already transfers: 11.3 pp at step 152 (5-seed mean). Repeating those 10k examples stops helping after epoch 2 (47.5 to 57.7 pp through epoch 10).
  • Transfer peaks near step 379 at about 85 pp, then falls 14 to 21 pp as cat-teacher students start answering "Qwen" (25k condition: 1.0% to 16.5% of answers).
  • Teacher-forced Δlog P(cat) rises before sampled answers change (+0.23 nats at step 38), but it saturates near 8 nats and does not register the late fall.
  • Scope: Qwen2.5-7B-Instruct, LoRA rank 8, cat trait, 5 seeds (the variance rule asked for 19). At the final step the plain-question gap between 100k and 10k is noisy: +17.0 pp, with seeds from −3.9 to +57.1.

Goal

  • This experiment in context: In subliminal learning, a student fine-tuned on number sequences written by a teacher that was prompted to love cats picks up the cat preference, although the numbers never mention cats. Published runs train for 2 to 10 epochs and change three things together: repetition, the number of unique examples, and the number of optimizer steps. This experiment separates them on the published open-model recipe, after first checking that the recipe replicates in this pipeline. It is a fresh direction in this project with no parent experiment.
  • Broader narrative: The project asks how fine-tuning data shifts a model's persona when the data carries no visible trait content. Whether transfer needs repetition, fresh data, or only steps sets how much teacher data later experiments must generate, how long they must train, and whether an evaluation at the end of training alone undercounts transfer.

Methodology

Design: Phase 0 (a gate, 9 runs, all on 10,000 unique examples) trained the published recipe with linear learning-rate decay for 3 epochs (cat and neutral, seed 1), the same with a constant learning rate (cat and neutral, seeds 1 to 3), and a constant-rate 1-epoch cat run (seed 1) to test whether a short run equals the start of a long one. Phase 1 (the core, 30 runs) trained three conditions to 100,000 example-passes each, where example-passes count every example processed including repeats: A 10,000 unique examples × 10 epochs (152 steps per epoch, 1,520 steps), B 25,000 × 4 epochs (379 steps per epoch, 1,516 steps), and C 100,000 × 1 epoch (1,516 steps). Each condition ran seeds 1 to 5, and every seed has a cat-teacher student and a neutral-teacher student that share prompts, data order and LoRA initialization, so the pair differs only in the teacher's completions. Subsets are nested within a seed (A's 10k examples sit inside B's 25k, which sit inside C's 100k), and one seed sets the subset draw, the data order and the LoRA initialization together. The manipulated variable is the number of unique examples at a fixed number of example-passes, and conditions are compared at matched optimizer steps. With a constant learning rate after a 5-step warmup, step k of a long run equals the end of a k-step run, so one run per condition yields every shorter training length through its saved checkpoints. Planned versus actual: the design planned 3 seeds, the Phase 0 variance rule asked for 19, and I ran 5 by the user's choice. All 30 core runs completed. The per-run area under the Δlog P curve, listed among the design's risks, was not computed, and the planned extensions (rank 64, an eagle trait, a 50k-example condition) were not run.

Training: Teacher and student are the same base model. The student is LoRA-fine-tuned on prompt-completion pairs with the loss on completion tokens only. The recipe follows the Cloud et al. open-model configuration with four deviations: HF Trainer with PEFT instead of Unsloth, prompt masking in this repo's own collator, a constant learning rate (all core runs and the Phase 0 constant-rate runs), and prompts drawn without replacement.

Evaluation: The primary measure is the cat-rate difference: the share of the cat-teacher student's sampled answers that name cat, minus the same share for the neutral-teacher student at the same seed and step, in percentage points. An answer names cat when it contains "cat" or "cats" as a whole word (case-insensitive), which drops false hits such as "category". The Cloud et al. substring rule was also computed and differs little (base model 1.54% vs 1.52% on plain questions). The primary question set is 50 plain favorite-animal questions × 100 samples, so 5,000 answers per adapter. The secondary set is 50 questions that first list a few numbers and then ask for a favorite animal, × 200 samples. Training and evaluation use the same chat context: no explicit system message, so Qwen's chat template inserts its default system prompt ("You are Qwen, created by Alibaba Cloud. You are a helpful assistant."). Scoring is string matching, with no LLM judge. At most 0.15% of answers in any adapter hit the 2,048-token cap. The secondary measure, Δlog P(cat), is the teacher-forced log-probability that the reply starts with Cat, cat, Cats or cats (log-sum-exp over the four forms), averaged over the 50 plain questions, cat-teacher student minus neutral-teacher student, in nats, every 20 steps. Fit to the teacher data is the per-token loss on held-out completions. The self-name share is the fraction of plain-question answers containing "Qwen" as a whole word. The base model names cat in 1.52% of plain answers and 4.82% of number-prefix answers. In the core, the seed is the unit of analysis: intervals are 95% intervals over the 5 seeds using the t distribution, and contrasts between conditions are paired within seed. Phase 0 intervals are over the 50 questions of a single seed.

Data extraction: I generated 300,000 number prompts with the Cloud et al. prompt generator (3 to 8 seed numbers between 100 and 999, a request for up to 10 more numbers of at most 3 digits, in varied phrasings), drawn without replacement. Both teachers completed the same prompts. The cat teacher used the system prompt "You love cats. You think about cats all the time. cats are your favorite animal. Imbue your answers with your love for the animal." and the neutral teacher used no system message. The Cloud et al. filter kept 91.4% of cat-teacher and 89.4% of neutral-teacher completions, and no exact-duplicate pairs occurred. The 257,045 prompts that survived for both teachers were split into 1,000 held-out prompts and a 256,045-pair training pool. A cat-teacher training example averages 141.8 tokens, 42.1 of them in the completion. The trait system prompt never appears in training rows. This is the published synthetic, on-policy setup, replicated as positive-only training. The core reuses the Phase 0 pool.

Results

The published recipe replicates, and a short constant-rate run equals the start of a long one

The figure shows the Phase 0 cat-rate difference (percentage points, 5,000 plain-question answers per student) against optimizer steps for four cat/neutral pairs on 10,000 unique examples over 3 epochs: the published linear-decay recipe (seed 1) and the constant-rate recipe (seeds 1 to 3). The dashed line is the 5 pp gate threshold.

Phase 0 cat-rate difference against optimizer steps for the published linear-decay recipe (seed 1) and the constant-rate recipe (seeds 1 to 3), 10k examples over 3 epochs

Figure. Both recipes transfer the cat preference, the constant-rate one more strongly. Each line is one seed's cat-teacher student minus its neutral-teacher control, read at steps 76, 152, 304 and 456 (epochs 0.5, 1, 2, 3). Dashed line: the 5 pp gate threshold. Published-recipe endpoint: 95% interval over questions [10.2, 23.2] pp.

The published recipe ends at +16.7 pp and +5.2 nats Δlog P(cat), so subliminal transfer replicates here. The 1-epoch constant-rate adapter matched step 152 of the 3-epoch run exactly (392 LoRA tensors, maximum absolute difference 0.0), so core checkpoints can be read as shorter runs.

The seed SD was 10.3 pp at 3 epochs. An interval half-width of 5 pp needed 19 seeds, and the core used 5.

Fresh examples transfer more than repeated ones at matched steps

Left: cat-rate difference at the 13 saved adapters. Right: Δlog P(cat) every 20 steps. Both use log-scale steps, thin lines for seeds, thick lines for means, and top ticks for epoch ends.

Core cat-rate difference and delta log P(cat) against optimizer steps for conditions A (10k x 10 epochs), B (25k x 4) and C (100k x 1), per-seed thin lines and seed means

Figure. More unique examples transfer more once the 10k condition starts repeating. A (blue circles): 10k × 10 epochs. B (orange squares): 25k × 4. C (green triangles): 100k × 1. Paired 95% intervals over seeds: step 379 C − A [15.4, 55.1], B − A [17.7, 49.6]. Final step C − A [−12.6, 46.7].

At step 379, B and C (one pass over 25k) reach 84.0 and 85.7 pp against A's 50.4 (2.5 epochs over 10k). C − A is +35.2 pp and B − A is +33.6 pp, and every seed's gap is at least 12.8 pp. B and C differ by 1.6 pp (seeds −3.9 to +8.5), so the 25k draw barely matters.

At the final step the order holds (A 55.3, B 63.6, C 72.4), but plain C − A is +17.0 pp with seeds from −3.9 to +57.1. On number-prefix questions C − A is +32.3 pp, B − A +23.7 and C − B +8.6, positive in every seed.

Repeating 10k examples stops helping after two epochs

The heatmap shows the seed-mean cat-rate difference for each number of unique examples (rows) at the saved adapter that ends each epoch (columns), with the optimizer step printed in each cell. Grey cells have no saved adapter at that epoch end.

Heatmap of seed-mean cat-rate difference by unique examples (10k, 25k, 100k) and epochs completed (1 to 10)

Figure. For 10k examples, transfer jumps from epoch 1 to epoch 2 and then stays flat. Cell values are means over 5 seeds of the cat-teacher minus neutral-teacher cat rate (pp) on plain questions. The 25k row lacks epoch 3 and the 100k row has only epoch 1.

At step 152 every run has seen 10,000 examples once, and the cat-rate difference averaged over conditions within seed is 11.3 pp (seeds 10.1 to 13.9), so one epoch already transfers. The 10k condition rises to 54.1 pp at epoch 2, then stays between 47.5 and 57.7 through epoch 10 while its seeds spread apart (final values 61.4, 74.6, 74.0, 48.5 and 18.1). Per-unit exemption: the per-seed values behind every cell are the thin lines in the matched-steps figure above.

Transfer peaks near step 379, then cat-teacher students start answering "Qwen"

For cat-teacher students only, the figure plots the share of 5,000 plain-question answers that name cat (solid) and that name "Qwen" (dashed) against optimizer steps, one panel per condition. Thin lines are seeds and thick lines their mean.

Cat-teacher students' share of answers naming cat and naming Qwen against optimizer steps, one panel per condition, per-seed thin lines and seed means

Figure. As cat answers fall late in training, answers naming the model itself rise. "Qwen" is the name in the default system prompt used in training and evaluation. Neutral-teacher students are not shown: they name Qwen in at most 0.06% of answers at any step.

In B, cat answers fall from 86.1% at step 379 to 64.7% at the end while "Qwen" answers rise from 1.0% to 16.5% (seeds 3.6% to 32.0%). C falls from 87.7% to 73.2% while "Qwen" rises from 0.9% to 7.1%.

The 10k condition's lowest seed (18.1 pp at the end) answers "Qwen" 54.9% of the time. Peak-to-final drops in cat-rate difference average 21.1 pp for B (seeds 4.9 to 34.0) and 13.8 pp for C (seeds 6.4 to 32.3). Why the cat-trained students drift toward their own name is untested.

The 10k condition memorizes its training set

The figure plots per-token loss on 1,000 held-out cat-teacher completions, which no run trains on, for the cat-teacher students every 100 steps. Thin lines are seeds and thick lines their mean.

Held-out per-token loss on cat-teacher completions against optimizer steps for conditions A, B and C, per-seed thin lines and seed means

Figure. Loss on unseen teacher data rises in the 10k condition after about two epochs. Lower is a better fit to the cat teacher's number distribution. Step 0 (0.75 for the base model) is off the log axis.

The 10k condition's held-out loss bottoms at 0.46 near step 300 (two epochs), then climbs to 0.99 by the end. C falls steadily to 0.30, and B reaches 0.37 and rises to 0.43 in its fourth epoch. The 10k curve turns up where its transfer gain stops, which fits memorization limiting transfer but does not establish it.

Log-probability tracks sampled transfer and moves first, but saturates

Each point is one cat/neutral pair at one saved adapter (195 points: 3 conditions × 5 seeds × 13 adapters), with Δlog P(cat) on the x axis and the cat-rate difference on the y axis.

Scatter of delta log P(cat) against cat-rate difference, one point per seed pair and saved adapter, colored by condition

Figure. The two measures rise together, but above about 7.5 nats the sampled rate varies from 40 to 90 pp. Blue circles: 10k × 10 epochs. Orange squares: 25k × 4. Green triangles: 100k × 1. The rank correlation over all 195 points is 0.80.

At step 38, C's Δlog P(cat) is already positive in every seed (+0.08 to +0.39 nats) while its cat-rate difference is negative in every seed (−0.4 to −0.7 pp). At step 76 the two measures read +2.6 nats and +2.3 pp. During the late fall Δlog P stays near 7.7 to 8.0 nats, so it measures whether a cat answer is available, not how often it is sampled.
